Abstract

While having enhanced NLP, deep learning and pre-trained language models requires a lot of processing power. The work showcases the potential of quantum computing by mapping linguistic data into vast, high-dimensional Hilbert spaces through entanglement and superposition. It focuses on mathematical concepts that set quantum approaches apart from classical ones, among them being the fidelity-based similarity and quantum probability.Various quantum machine learning models are considered in this article, including Quantum Neural Networks and Quantum Support Vector Machines, each discussing the computational advantages in pattern recognition. In addition, it considers retrieval techniques like Grover's algorithm, showing how quantum similarity functions give better semantic search.Indeed, the comparison does show that quantum techniques might yield advantages regarding expressiveness and scalability, despite obstacles such as hardware noise and data encoding.Notwithstanding that quantum technology is still in its infancy, future improvements might advance language understanding.

Quantum Natural Language Processing: A Comprehensive Review of Models, Methods, and Applications

Farha Nausheen, Khandakar Entenam Unayes Ahmed, Mumit Khan +1 more

In recent developments, deep learning methodologies applied to Natural Language Processing (NLP) have revealed a paradox: They improve performance but demand considerable data and resources for their training. Alternatively, quantum computing exploits the principles of quantum mechanics to overcome the computational limitations of current methodologies, thereby establishing an emerging field known as quantum natural language processing (QNLP). This domain holds the potential to attain a quantum advantage in the processing of linguistic structures, surpassing classical models in both efficiency and accuracy. In this paper, it is proposed to categorise QNLP models based on quantum computing principles, architecture, and computational approaches. This paper attempts to provide a survey on how quantum meets language by mapping state-of-the-art in this area, embracing quantum encoding techniques for classical data, QNLP models for prevalent NLP tasks, and quantum optimisation techniques for hyper parameter tuning. The landscape of quantum computing approaches applied to various NLP tasks is summarised by showcasing the specific QNLP methods used, and the popularity of these methods is indicated by their count. From the findings, it is observed that QNLP approaches are still limited to small data sets, with only a few models explored extensively, and there is increasing interest in the application of quantum computing to natural language processing tasks.

Integrating Quantum Computing with Deep Learning for Enhanced Natural Language Processing

Anand Singh Rajawat, Hussein Mohammed Breesam, Shruti Goyal

Quantum computing with its capacity to compute multiple possibilities at once, and perform some kinds of calculations almost instantly is one leading edge. The integration of QCs and DL undoubtedly represent one such transformative means for improving Natural Language Processing (NLP). By combining the two, this uses quantum principles of superposition and entanglement to make computation faster regarding human language comprehension limitations in classical computing. Deep learning models, specifically neural networks have already made significant improvements over NLP tasks like language translations, sentiment analysis and text generation. Nevertheless, these models also face scalability and computational efficiency issues with huge volumes of data. Quantum computing offers a solution to all this by reducing the time exponentially that it takes to fetch large amounts of language data and running deep learning algorithms. This paper investigates the opportunities that integrating quantum computing and deep learning into NLP practices might unlock. We drafted the fundamentals of quantum computing and why it is a need over classical computing, where we discussed on how quantum beneficial for data processing & optimization of an algorithm. We then explore applications of quantum enhanced deep learning for NLP, with a focus on the impact that training and inference can have on model performance. We demonstrate the utility of this integration by integrating our four SQDs to showcase improvements on diverse NLP tasks through a series of experiments and case studies. We also demonstrate that hybrid quantum-classical approaches allow the combination of traditional ML and quantum-enhanced models, achieving state-of-the-art performance with respect to effectiveness, scalability and precision

Natural Language Processing With Hybrid Quantum Neural Networks

Manju Lata Joshi

The recent developments in the field of deep learning have made Natural Language Processing (NLP) quite useful, but there are still issues of the complexity of computation, energy consumption, and modeling of complex semantics. Representations and optimization techniques that are quantum enhanced are available in quantum computing and provide new possibilities. Hybrid Quantum Neural Networks (HQNNs) combine quantum computational concepts and classical neural networks, allowing the introduction of a new era in intelligent language processing. The chapter provides the basics of quantum computing and neural NLP models and looks at the hybrid methods of semantic representation and learning. The text classification, sentiment analysis, named entity recognition, and machine translation tasks that are fundamental to NLP are examined through a hybrid quantum-neural approach. Such methods as quantum data encoding, quantum feature extraction and hybrid training approaches are described and the issues associated with scalability, noise, and hardware limitations are discussed.

Quantum Techniques for Optimizing Algorithms in Natural Language Processing

Dalydas Karanath, Udai Shankar

This research paper explores how Natural Language Processing (NLP) algorithms can be enhanced through the use of quantum computing. Since NLP applications such as sentiment analysis, text classification, and machine translation analyze huge volumes of data, the amount of resourceconsuming work for traditional computing architectures, including large scale language models, becomes excessive. There is an opportunity for significant improvements in speed and efficiency because of the quantum properties of superposition and entanglement. This research explores the use of quantum algorithms such as Grover's search, quantum machine learning algorithms, and quantum-inspired tensor networks for alleviating computational NLP bottlenecks. The comparative study of the quantum approach against the classical method shows notable speedup in theory with an explanation of the implementation of quantum algorithms on Noisy IntermediateScale Quantum (NISQ) devices. The most promising NLP algorithm enhancement will most likely come from hybrid quantum-classical sophisticated architectures as discovered through this study, where quantum processing is applied to some components and classical processing is used for the rest of the quantum-classical NLP algorithms. This is the first research study in Quantum Natural Language Processing (QNLP) for real world NLP applications and the author is commended for their efforts.

Quantum Machine Learning Techniques for High-Performance Pattern Recognition

Isha Sethi

Quantum computing has emerged as a radical paradigm of computationally tasks which cannot be achieved through classical systems. Quantum Computer-Assisted Machine Learning (Quantum Machine Learning) The use of quantum mechanics and principles of artificial intelligence, such that the quantum mechanics principles of superposition, entanglement and tunnelling are used to improve pattern recognition. Big data dimensions, exponential growth feature space, optimization bottlenecks will not be effectively handled using currently available machine learning algorithms. It is anticipated that QML will deliver factors-of-four to exponential training and inference gains, especially on high-performance pattern recognition tasks in on-the-edge applications, including image processing, natural language processing, and cybersecurity. This is a review article of quantum machine learning (high-performance pattern recognition). It studies some of the underlying paradigms of quantum support vector machine (QSVMs), quantum k-means clustering, variational quantum circuits (VQCs) and quantum-classical deep learning systems. The benefits of QML are addressed in relation to scalability, generalization, and resilience of high dimensional data space. Such use cases include biomedical imaging, business fraud, and material discovery. The QML does have several opportunities, but is restricted by noisy intermediate-scale quantum (NISQ) machines and error correction costs, and cannot be as easily co-located with classical pipes. Another objective of this paper is to discover the significance of the hybrid quantum-classical models that are the most realistic line of attack today, to the application of quantum techniques. The next line of research is hardware-efficient algorithms, quantum feature maps, and practical benchmarking of QML. The quantum computing-artificial intelligence interface can be the new frontier to highly-performing, scaled-out, and efficient pattern recognition systems in data-focused industries, QML may become the future of computation.
