Abstract

This paper proposes a novel approach to quantum annealing optimization by integrating quantum annealing's inherent properties with machine learning-driven adaptive parameter tuning. The core idea revolves around a machine learning agent – typically a reinforcement learning model – which dynamically monitors the quantum annealing process, specifically tracking parameters such as amplitude, time scale, and the transfer matrix. Based on the observed characteristics of the optimization problem, the agent autonomously adjusts these parameters in real-time, aiming to significantly improve both the efficiency and accuracy of solving complex optimization problems. This adaptive methodology contrasts with traditional quantum annealing, which relies on pre-defined parameters, offering increased flexibility and adaptability. We demonstrate a theoretical framework and a conceptual outline of this adaptive quantum annealing algorithm, highlighting its potential advantages and future research directions. The key mathematical formulations and notations used throughout the paper are presented in plain text.

Adaptive Quantum Annealing Algorithm

Jincheng Zhang

This paper presents an Adaptive Quantum Annealing Algorithm (AQA), designed to enhance the solution efficiency of complex optimization problems. The core idea is to dynamically adjust parameters within the quantum annealing process, such as the annealing rate and path, using a machine learning-based feedback mechanism. Specifically, a reinforcement learning algorithm is employed to monitor the quantum annealing process in real-time, analyzing its state and adjusting the annealing parameters accordingly. This adaptive approach allows the algorithm to tailor its behavior to the specific characteristics of each problem, potentially overcoming limitations of traditional, static quantum annealing methods. The algorithm's performance is evaluated through simulation, demonstrating its ability to achieve improved results compared to standard quantum annealing strategies. The key contributions of this work lie in the integration of quantum annealing with adaptive optimization, enabling a more robust and efficient solution for diverse optimization challenges. The algorithm's design provides a framework for future research in hybrid quantum-classical optimization techniques.

Adaptive Quantum Annealing for Combinatorial Optimization

Jincheng Zhang

This paper presents an adaptive quantum annealing algorithm designed to improve the performance of quantum annealing in solving combinatorial optimization problems. Traditional quantum annealing relies on a fixed annealing schedule, which may not be optimal for all problems. This work introduces a novel approach that utilizes reinforcement learning to dynamically adjust the annealing parameters during the annealing process, based on the observed progress towards a solution. The algorithm learns an optimal annealing schedule by interacting with the quantum annealing system, maximizing the probability of finding a good solution within a given time limit. We demonstrate the theoretical framework and outline the core components of the adaptive algorithm, highlighting its potential advantages over conventional fixed-schedule quantum annealing. The key performance metric is the solution quality (e.g., objective function value) achieved after annealing. The algorithm's effectiveness is evaluated through conceptual analysis and design considerations. This approach aims to bridge the gap between the theoretical potential of quantum annealing and its practical application in solving real-world combinatorial optimization challenges.

Adaptive Quantum Machine Learning Dynamic Parameter Adjustment

Jincheng Zhang

This paper explores the application of adaptive quantum machine learning (QML) to dynamic parameter adjustment, aiming to enhance model generalization and efficiency. Traditional parameter optimization methods often rely on manual adjustments, limiting their adaptability and potential for improved performance. We propose a novel framework leveraging quantum circuits' inherent adaptability to automatically adjust parameters, thereby facilitating more efficient training and improved generalization. The core mechanism centers on quantum circuit self-tuning, enabling the model to explore a wider parameter space, leading to better predictive accuracy and reduced overfitting. Adaptive Quantum Annealing Optimization Algorithm

Jincheng Zhang

This paper presents an Adaptive Quantum Annealing Optimization Algorithm (AQAO) designed to address the limitations of traditional quantum annealing approaches in tackling complex, non-convex optimization problems. The core of the AQAO lies in its dynamic analysis of the objective function's energy landscape and the subsequent adaptive adjustment of annealing parameters. Unlike conventional quantum annealing, which often employs fixed parameters, the AQAO continuously monitors the quantum annealing process and adjusts parameters such as the annealing rate and jump probability based on real-time changes in the energy landscape. This adaptive mechanism aims to accelerate convergence towards optimal solutions by effectively responding to the evolving complexities of the optimization problem. The algorithm leverages the inherent search capabilities of quantum annealing while mitigating the issues of slow convergence or failure to find global optima frequently encountered with static parameter settings. The theoretical framework and algorithmic design are presented, emphasizing the key improvements and potential advantages of the AQAO compared to existing methods. The focus is on the adaptive control strategy, providing a robust approach to complex optimization challenges.

Quantum-Inspired Optimization of Reinforcement Learning Policies

Jincheng Zhang

This paper investigates the potential of utilizing quantum-inspired optimization techniques to enhance reinforcement learning (RL) policies. Traditional RL algorithms often suffer from slow convergence and can be trapped in local optima. We propose leveraging quantum annealing, a prominent quantum computing paradigm, to optimize the policy parameters within an RL framework. The core idea is to map the policy optimization problem onto an Ising model, which is then solved using quantum annealing algorithms. This approach aims to provide a more efficient search process, potentially leading to faster learning rates and improved policy performance. We explore the theoretical underpinnings of this approach and present a conceptual framework for its implementation. The primary focus is on demonstrating the feasibility and potential benefits of this novel hybrid approach, rather than a full-fledged experimental validation due to the limitations of current quantum annealing hardware. The paper concludes with a discussion of future research directions and challenges.
