Quantum Machine Learning: A Reinforcement Learning Framework

Jincheng Zhang

Quantum Machine Learning (QML) represents a paradigm shift in machine learning, leveraging quantum mechanical principles to accelerate computation and potentially unlock new algorithms. This paper investigates a novel reinforcement learning (RL) framework, termed "Adaptive Neural Network Reinforcement Learning" (ANNR), which employs dynamic parameter adjustment within a self-adaptive neural network to enhance learning efficiency and generalization capabilities. We demonstrate that this approach overcomes limitations of traditional RL methods, offering a promising path towards more robust and adaptable reinforcement learning agents. The core mechanism focuses on iteratively refining neural network weights through a feedback loop, enabling the system to explore complex environments effectively. The research explores the impact of parameter adjustment on both training speed and final performance across various RL tasks.

Q-Drop: Optimizing Quantum Orthogonal Networks with Statistic Pruning and Dynamic Dropout

Pham Thai Quang Nguyen, Tran Cat Khanh, Yared Abera Ergu +1 more

Quantum machine learning (QML) holds immense potential for revolutionizing computational intelligence, yet faces significant challenges in optimizing quantum neural network architectures for practical implementation. This paper introduces Q-Drop, an innovative quantum adaptation technique that enhances parameterized quantum circuits (PQCs) for training performance. The system includes two novel optimization strategies: statistical pruning and dynamic dropout (circuit flipflops), which significantly improve the learning performance and robustness of quantum orthogonal neural networks. Evaluation results across standard (MNIST, Fashion-MNIST) and medical imaging (Pneumonia-MNIST, Retina-MNIST) datasets demonstrate substantial performance gains. Notably, the approach achieves up to 94.3 % accuracy on medical image classification and 98.7 % accuracy on standard image datasets, outperforming existing quantum machine learning methods. By addressing critical challenges in quantum neural network training, this work highlights the potential of applying quantum machine learning to enhance performance for classical computer vision tasks and QML-driven scheduling optimization in quantum networks.

SAQNN: Spectral Adaptive Quantum Neural Network as a Universal Approximator

Jialiang Tang, Jialin Zhang, Xiaoming Sun

Quantum machine learning (QML), as an interdisciplinary field bridging quantum computing and machine learning, has garnered significant attention in recent years. Currently, the field as a whole faces challenges due to incomplete theoretical foundations for the expressivity of quantum neural networks (QNNs). In this paper we propose a constructive QNN model and demonstrate that it possesses the universal approximation property (UAP), which means it can approximate any square-integrable function up to arbitrary accuracy. Furthermore, it supports switching function bases, thus adaptable to various scenarios in numerical approximation and machine learning. Our model has asymptotic advantages over the best classical feed-forward neural networks in terms of circuit size and achieves optimal parameter complexity when approximating Sobolev functions under $L_2$ norm.
